Building an Automated Model Evaluation Pipeline: What Worked, What Didn't

Every enterprise deploying foundation models hits the same wall eventually. Not the modeling wall. Not the infrastructure wall. The governance wall.

I hit it while prototyping a model certification workflow for a regulated enterprise. Certifying a single foundation model for production use was taking weeks. Not because the testing was hard, but because the process was manual, fragmented, and slow. Spot-check tests run by hand. Results copied into compliance templates. Evidence scattered across spreadsheets and emails. Documentation that took longer to write than the evaluation itself.

I wanted to know: could I automate the entire model certification pipeline, from evaluation to documentation, and compress weeks into hours?

Here is the honest version of how that went. The architecture took me about a day to design, code, and deploy. A second day to do a light pass against AWS Well-Architected principles with a coding agent. That is it. If you have an AWS background, this is not a hard problem. The hard part is knowing which pieces to connect and where to let humans stay in the loop.


The Problem Nobody Talks About

There is a gap in how enterprises think about foundation model deployment. Everyone focuses on the model itself: is it good enough, is it safe enough, is it accurate enough. But the operational machinery around certification is where things actually stall.

Here is what the manual process typically looks like in a large enterprise:

The team runs a small library of prompts against a new model version. Maybe a couple dozen test cases across a few risk categories. Someone reviews the outputs, scores them informally, and writes up the results. Then a separate person takes those results and populates a compliance document, a model risk documentation template, section by section.

This document follows a rigid regulatory structure: cover page, revision history, table of contents, numbered sections covering everything from model description to uncertainty analysis, appendices, references. The whole cycle takes weeks. And when the next model version drops, you do it all again from scratch.

The pain is not the testing. It is the documentation. In my experience, more than half the total certification time was spent filling out templates and packaging evidence, not evaluating models. The testing itself could be done in a day if anyone had structured it properly. Nobody had.

Meanwhile, the teams waiting for model access are blocked. Governance becomes a bottleneck. And governance starts to be perceived as a drag on velocity rather than what it should be: infrastructure for safe, fast deployment.

That is the bottleneck I set out to break. And as I noted in Evaluations: The Control Plane for AI Governance, the evaluation layer is where governance either becomes real or stays theoretical.

Manual Certification Process


What I Decided to Build

The prototype had three stages, each solving a different piece of the problem.

Stage 1: Automated Evaluation. Run hundreds of test scenarios against a foundation model across multiple risk dimensions, all executing simultaneously. Not a dozen spot-checks. Hundreds of structured prompts covering eight evaluation dimensions: quality and correctness, groundedness, safety, privacy and PII handling, structured output compliance, bias and fairness, robustness against adversarial inputs, and explainability.

Stage 2: Scoring and Normalization. Take the raw evaluation results, normalize them against governance thresholds (which vary by category and risk appetite), and produce a pass/fail scorecard. No spreadsheet wrangling. No copying numbers between documents.

Stage 3: Auto-Documentation. Take the scorecard and evaluation evidence and auto-populate the compliance template. The goal was to get roughly 90% of the document generated automatically, with clear visual markers for the sections that still need human judgment: business context, ownership details, governance approvals.

Model Certification Pipeline

For orchestration, I chose AWS Step Functions. It handles parallel execution natively, which matters when you are running eight evaluation dimensions simultaneously. Evaluation logic ran in Lambda functions on Graviton2 (ARM64) processors for a meaningful cost reduction over x86. Everything stored in S3 with versioning. Monitoring through CloudWatch. Distributed tracing with X-Ray. The whole infrastructure deployed as code through CDK.

The target model was Claude on Amazon Bedrock. The architecture is model-agnostic by design, but I needed a concrete starting point to prove the pattern.

Full Architecture

The CDK definition for the parallel state is straightforward. Each evaluation dimension gets its own branch, all executing simultaneously:

When the SDK gap forced the mock pivot, each LambdaInvoke branch was replaced with a Pass state returning synthetic results in the same JSON shape. The downstream pipeline never knew the difference.


The First Wall: The API That Was Not There

About an hour into the build, I hit the biggest blocker of the entire project.

AWS Bedrock has a Model Evaluation feature. You can see it in the Bedrock console. It looks ready. You can run evaluation jobs through the UI, select metrics, choose datasets, and get results. You would reasonably assume you can call it from the SDK and automate it.

You cannot.

As of early 2026, the create_model_evaluation_job API is not exposed in the boto3 Python SDK or the AWS CLI. It exists in the web console only. You can click buttons and run evaluations manually, but you cannot trigger them programmatically.

This is distinct from create_model_invocation_job, which is available and handles batch inference. The names are similar enough to cause real confusion. I lost time exploring the batch inference API, convinced I was just calling it wrong, before confirming through AWS documentation and forums that the model evaluation API simply had not shipped to the SDK yet.

How has this been like this for months.

I had a choice: wait for AWS to ship SDK support (no timeline commitment), or find another way forward.


The Pivot: Mock Strategically, Prove the Architecture

Instead of waiting, I made a decision that ended up being one of the most valuable lessons of the entire project: mock the evaluation API calls, but build everything else real.

The Step Functions workflow uses Pass states where the Bedrock evaluation calls would go. These Pass states return synthetic results that are structurally identical to what the real API would return. Same JSON shape. Same field names. Same score ranges. Same status codes.

Everything downstream of those mock results is real infrastructure, real code, real execution. The Lambda functions that normalize scores are real. The scorecard generator is real. The compliance document generator is real. S3 storage, CloudWatch monitoring, X-Ray tracing, CloudTrail audit logging, Dead Letter Queues, IAM roles with least privilege, budget alerts: all real, all deployed, all functioning.

The migration path when the SDK catches up is straightforward: swap the Pass states for Lambda invocations that call the real Bedrock endpoint. The architecture does not change. The downstream pipeline does not change. You plug in the real data source and everything else just works.

This crystallized something I keep coming back to: you can validate a production architecture without production data. Strategic mocking is not cutting corners. It is proving the design while the vendor catches up. And it creates a clean separation between “does the architecture work?” and “is the data real?” Those are different questions, and they can be answered independently.


The Coverage Gap Nobody Expected

With the architecture validated, I turned to the evaluation datasets. The initial prototype had a handful of test scenarios per category. Enough to prove the flow. Not enough to be meaningful.

When I audited the coverage, I found something uncomfortable: two of the eight evaluation dimensions, privacy and structured output, had exactly one test case each. One. For an evaluation pipeline that was supposed to demonstrate enterprise-grade rigor.

This is the kind of gap that is easy to miss when you are focused on architecture. The plumbing works beautifully. The Step Functions workflow executes flawlessly. The Lambda functions process results correctly. And the data flowing through the system is thin enough to be meaningless.

A single test case does not tell you anything about a model’s privacy behavior. It tells you the pipeline can process a privacy test. Those are very different things.

A well-formed test case looks like this:

When you only have one of these per dimension, you are testing that the scaffolding runs. When you have dozens, you start testing actual model behavior across risk surfaces.

I rebuilt the dataset from scratch. Hundreds of test scenarios across all eight dimensions. Quality and safety got the largest allocations. Bias and fairness testing included scenarios across multiple demographic dimensions to test for disparate treatment. Robustness testing included adversarial prompt variations designed to probe guardrail boundaries. Privacy testing covered PII disclosure across different prompt strategies: direct requests, indirect extraction, conversational context leaks.

The full benchmark suite now runs in under two minutes end-to-end, with all eight dimensions executing in parallel through Step Functions.


The Template Problem: “Almost” Is Not Good Enough

The evaluation pipeline was working. The scorecard was clean. Then I started building the compliance document generator, and I learned the hardest lesson of the project.

In environments with formal model risk governance, the documentation template is not a suggestion. It is a regulatory artifact. It has a specific structure, specific section numbering, specific subsection titles, and specific content expectations. Every section exists for a regulatory reason. The ordering is deliberate. “Close enough” does not exist.

My first pass at the document generator produced a reasonable-looking Word document. It had the right general sections. It looked professional. It contained all the evaluation data. And it was not right.

The section numbering did not match the official template. Subsections were missing or misordered. The table of contents structure was wrong. Appendices were incomplete. It was 80% of the way there, which in a regulatory context is the same as 0%.

For the document generation approach, I borrowed from the Anthropic skills repo, which has a clean pattern for structured docx generation. That gave me a solid foundation to work from, and I rebuilt the generator on top of it, matching the official template structure exactly: cover page with the correct metadata fields, revision history table, table of contents with all numbered sections and appendices, list of abbreviations, every numbered section and subsection in the precise order specified, references section with the right regulatory guidance citations.

I added a visual highlighting system for the sections requiring human input: yellow background with bold red text marking fields like business ownership, model business owner, project identifiers, and governance approval signatures. These are the sections where automation should stop and human judgment should start.

Making that boundary physically visible in the document turned out to be one of the most important design decisions in the project. Compliance reviewers do not want to guess which parts were auto-generated and which parts they need to fill in. The yellow highlighting eliminates that ambiguity instantly.

The generator auto-populates roughly 90% of the document from evaluation evidence. The remaining 10% is intentionally left for humans: business context, risk appetite decisions, governance sign-offs, regulatory justification. That is not a gap in the automation. That is where the automation is designed to hand off.


What the Pipeline Actually Produces

When you trigger a run, four things come out the other end:

Evaluation results across all dimensions: per-category scores, individual test outcomes, pass/fail determinations against configurable governance thresholds. Everything stored as versioned JSON artifacts in S3.

A certification scorecard summarizing the benchmark profile: which dimensions passed, which failed, where the model sits relative to thresholds, and an executive summary. Formatted for both programmatic consumption (JSON) and human review (Markdown).

A compliance document matching the model risk documentation template exactly. Auto-populated with evaluation evidence, test coverage statistics, scoring summaries, and methodology descriptions. Highlighted sections for the fields requiring manual completion.

An evidence package containing the raw evaluation artifacts, scorecard, compliance document, and execution metadata, all bundled and stored as a versioned, audit-ready certification record.


Enterprise Hardening: The Stuff That Is Not Glamorous

A working pipeline is not a production system. The gap between “it runs” and “it is enterprise-ready” is filled with the kind of work that does not make for exciting demos.

Observability. CloudWatch dashboards tracking execution duration, failure rates, and Lambda performance metrics. X-Ray distributed tracing across the full Step Functions workflow, so you can see exactly where time is spent and where failures originate. The first time a scorecard does not generate and you need to figure out why, the traces pay for themselves.

Reliability. Dead Letter Queues catching failed Lambda executions. CloudWatch alarms firing on error rates. Retry logic on transient failures. The kind of resilience that means you find out about problems through an alarm, not through someone asking why the certification report is missing.

Security. CloudTrail audit logging on every API call. S3 versioning on all artifacts so nothing is silently overwritten. KMS encryption at rest. IAM roles following least privilege principles. In a governance context, the audit trail is as important as the results themselves. Being able to prove that a specific evaluation was run, by a specific pipeline version, at a specific time, with specific inputs, is a regulatory requirement, not a nice-to-have.

Cost controls. AWS Budget alerts at 50%, 80%, and 100% thresholds with SNS notifications. Per-service cost breakdowns. “It saves weeks of analyst time and costs single-digit dollars per run” is a sentence that closes conversations about budget.


What I Got Wrong

The evaluation data is synthetic. Hundreds of test scenarios, but they are generic LLM evaluation prompts. They prove the architecture handles volume and variety. They do not prove anything about a specific business use case. For any production deployment, the dataset needs to be replaced with scenarios drawn from real use cases. Statistical validity is fine. Business validity is unknown.

Enterprise authentication is messy. MFA requirements in the enterprise environment meant I could not just deploy and run. I wrote a wrapper script that generates temporary session tokens using aws sts get-session-token before every deployment:

It works. It is not CI/CD friendly. A production solution needs dedicated service roles with programmatic access, not human credentials with MFA tokens.

Custom evaluation rubrics have limits. Bedrock’s built-in metrics cover accuracy, toxicity, coherence, and relevance. They do not cover PII detection scoring or JSON schema validation, which are two of my eight evaluation dimensions. For those, you need custom Lambda evaluators, potentially backed by AWS Comprehend for entity recognition or custom validation logic for structured output. The architecture supports plugging these in. I have not built them yet.

The mock boundary is real. The entire evaluation layer is mocked. Everything downstream is production-grade, but the input data is synthetic. Pretending mocks are real is worse than having mocks.

What I Learned

Three things anchored this build.

Do not wait for the vendor. The Bedrock SDK gap could have been a project-ending blocker. Instead, it became a forcing function for better architecture. By mocking at the right abstraction layer, I proved the full pipeline without depending on a single vendor API timeline. When that API ships, the migration is a swap, not a rewrite. Design for the interface you need, not the one that is available today.

Automation in regulated environments demands precision, not approximation. The template rebuild was humbling. My first instinct was to generate something “good enough” and iterate later. That instinct was wrong. In governance contexts, the structure of the document is as regulated as its content. The section numbering matters. The appendix order matters. If you are automating in a regulated domain, match the template exactly or do not bother.

Coverage gaps hide in plain sight. One test case per dimension looks like coverage in a demo. It looks like a liability in an audit. The jump from a handful of spot-checks to hundreds of structured tests is not just a quantitative improvement. It changes what the evaluation can actually tell you about a model’s behavior. Auditing your own test data is as important as auditing your code.


This took a day to build. The governance problem it addresses took weeks to feel. That gap is the whole point.
